Abstract: Contemporary automation systems require accurate models for analysis, design, and control. Oftentimes, it is not possible to derive satisfactory models by first principles. This is often the case in process engineering or in mechatronic systems, where the overall process is just too complex, or the development of those first-principle models would just be too expensive. Thus, there is a strong demand for data-driven modeling approaches. Additionally, there are enormous successes in machine learning concerning the generation of models solely by the use of data.
Driven by the need for accurate models as well as the successes and advances in machine learning, a novel class of model structures and associated training algorithms for building data-driven nonlinear dynamic models is developed. The new identification procedure and the resulting model is called local model state space network (LMSSN). It fuses nonlinear state space models with local model networks (LMNs). The LMSSN is designed as a user-friendly and deterministic approach with warm-start initialization (with a linear model), incrementally growing complexity, favorable and robust extrapolation behavior, easy interpretation, and straightforward incorporation possibilities for prior knowledge.
Furthermore, recurrent neural networks (RNNs) and their similarities to nonlinear state space models are elaborated on. Popular RNNs like the long short-term memory (LSTM) and gated recurrent unit (GRU) models are translated into controls perspective and a comprehensive study comparing different RNN structures is carried out.
The overall outstanding performance of the LMSSN is demonstrated on various applications. It is shown that the LMSSN can accurately model a wide variety of processes by consistently computing expressive yet compact models. The LMSSN is benchmarked against state-of-the-art nonlinear system identification algorithms and achieves similar or superior results. The practical usefulness and applicability of LMSSN are strikingly demonstrated on two real-world processes.

Abstract: Ein genaues und zuverlässiges Modell ist die Grundlage für Analyse, Auslegung und Regelung von modernen Automatisierungssystemen. Es ist häufig zu kompliziert, zu teuer oder zu ungenau, diese Modelle basierend auf physikalischen Gleichungen zu entwickeln. Innerhalb der letzten Jahre hat maschinelles Lernen deutliche Fortschritte bei der Verwendung von Daten zur Erstellung dieser Modelle gemacht. Ein wesentlicher Nachteil dieser Methoden ist, dass Stabilität der identifizierten Modelle nicht garantiert ist. Daher werden in dieser Arbeit Methoden zur Identifikation basierend auf FIR Modellen untersucht. Diese enthalten keine Rückkopplung und garantieren deshalb strukturbedingt Stabilität.
Lineare FIR Systeme bieten signifikante Vorteile aufgrund der einfachen Interpretierbarkeit ihrer Impulsantwort sowie ihrer inherenten Stabilität. In der jüngeren Literatur wurden neue Verfahren zur Vermeidung hoher Parametervarianz durch Wahl einer speziellen Tikhonov-Regularisierung vorgestellt. In dieser Arbeit werden diese Ansätze erweitert, um ein gezieltes Einbringen von Vorwissen zu ermöglichen. Die entwickelte Methode ist sowohl für Gray-Box-Identifikationsverfahren als auch für Ordnungsselektionsverfahren nutzbar. Die Anwendbarkeit wird anhand eines Laborsystems demonstriert.
Lokale Modellnetze ermöglichen die Erweiterung linearer Identifikationsverfahren auf nichtlineare Systeme. Hierbei wird der Regularisierungsmechanismus, der im Rahmen der linearen Verfahren angewendet wird, zur Identifikation der lokalen FIR Modelle genutzt. Besonders für Identifikationsprobleme mit schlechtem Signal-Rausch-Verhältnis zeigt die Methode deutlich bessere Ergebnisse als lokale Modelle mit Rückkopplung des Ausgangs.
Schließlich wird das maschinelle Lernen mit convolutional neural networks untersucht. Das Verhältnis zwischen diesen und blockorientierten nichtlinearen Systemen wird analysiert. Es wird eine spezifische Struktur von tiefen neuronalen Netzen basierend auf FIR Modellen als Netzbestandteilen vorgeschlagen. Bei der Identifikation des neuronalen Netzes wird der gleiche Regularisierungsansatz wie zur Identifikation linearer FIR Modelle verwendet. Es wird gezeigt, dass der Bias-Varianz-Tradeoff dadurch vorteilhaft beeinflust wird und der Ansatz auf einem aktuellen Benchmarkproblem mit den Ergebnissen von Methoden, die dem aktuellen Stand der Forschung entsprechen, verglichen. Hierbei werden vergleichbare Ergebnisse erzielt und zusätzlich glattere interne Impulsantworten und die Stabilität des Systems garantiert.

Abstract: The extrapolation behavior and its consequences of two different state space models is studied. More specifically, the extrapolation behavior of the local model state space network (LMSSN) is compared to the polynomial nonlinear state space model (PNLSS). Both approaches represent favorable alternatives in the light of their results on recent benchmark studies. The models are compared with regards to their static extrapolation behavior and their tendency to erratic behavior if test amplitudes grow larger than training amplitudes. It is shown on a Hammerstein and Wiener artificial test process that the PNLSS shows severe shortcomings concerning stability when operated close to or outside the boundaries in which it was trained. The LMSSN instead shows more favorable behavior in extrapolation and does only exhibit minor erratic behavior. If the process is inherently polynomial in some way, the PNLSS outperforms other models in extrapolation, as shown on the Silverbox benchmark test.

Abstract: Two new methods for optimization of passive step-based excitation signals for system identification of nonlinear dynamic processes via a genetic algorithm are introduced - an optimized Amplitude Pseudo Random Binary Signal (APRBSOpt) and a Genetic Optimized Time Amplitude Signal (GOATS). The investigated optimization objectives are the evenly excitation of all frequencies and the uniform data distribution of the space spanned by the system's input and output. The results show that the GOATS optimized according to the uniform data distribution outperform the state-of-the-art excitation signals standard ARPBS (APRBSStd), Optimized Nonlinear Input Signal (OMNIPUS), Chirp and Multi-Sine in the achieved model quality on three artificially created Single-Input Single-Output (SISO) nonlinear dynamic processes. However, the APRBSOpt only exceeds the Chirp, Multi-Sine and APRBSStd in the achievable model quality. Additionally, the GOATS can be used for stiff systems, supplementing existing data and easy incorporation of constraints.

Abstract: Eine zentrale Fragestellung im Forschungsbereich der methodischen Gesamtsystemauslegung hybrider Antriebsstränge ist die Beherrschung der Komplexität bezüglich der Varianten- und Anforderungsvielfalt. Die existierenden methodischen Ansätze basieren auf der Identifikation optimaler Systemauslegungen bezüglich vorab definierter Anforderungen an den Antriebsstrang. In dieser Arbeit wird die Möglichkeit zur Substitution bestimmter Leistungsklassen im Antriebsportfolio durch Hybridkonzepte untersucht, deren Systemleistung maßgeblich durch das elektrische Antriebssystem definiert ist. Die signifikante Reduzierung der Verbrennungsmotorleistung im Systemverbund gegenüber konventionellen Antrieben erfordert im Kontext der Kundenrelevanz eine überprüfung der bisherigen Anforderungen an nicht elektrifizierte Antriebsstränge.

Die in dieser Arbeit vorgestellte Methode identifiziert im Gegensatz zu bekannten Untersuchungen erstmals die Bedarfe der leistungsseitigen und energetischen Auslegung des elektrischen Antriebssystems sowie des elektrischen Energiespeichers, welche sich durch die Erfüllung bisheriger Antriebsstranganforderungen ergeben. Die zusätzliche Beeinflussung des Fahrkomforts spannt ein Spannungsfeld aus Antriebseffizienz, Leistungsfähigkeit und Fahrkomfort auf, in welchem die für eine Entscheidungsfindung relevanten gesamtsystemischen Zusammenhänge analysiert werden. Hierzu werden systemische Stellhebel wie zum Beispiel eine Reduzierung der Höchstgeschwindigkeit identifiziert und deren Einfluss auf eine kundenrelevante Auslegung des Hybridkonzepts bewertet. Visualisierungstechniken aus dem Bereich des maschinellen Lernens stellen im Verlauf dieser Arbeit eine transparente und nachvollziehbare Grundlage für einen fundierten Konzeptentscheid bereit. Des Weiteren werden bekannte optimierungsbasierte Betriebsstrategieansätze um Methoden der Fuzzy-Logik hinsichtlich der Lösung der Problemstellung erweitert. Letzteres wird insbesondere durch die Berücksichtigung zeitfensterbasierter Analysemethoden zur vollständigen Charakterisierung der Leistungsanforderungen an die elektrischen Komponenten ermöglicht.

Abstract: In the calibration of modern combustion engines, stationary model-based approaches are common. For future developments, the use of dynamic data-based modeling is an important and required step to further increase the efficiency and quality of the calibration process. In order to achieve high modeling quality, these models require informative measurement data. This necessitates a transient variation of the input signals during the measurement process. At the same time the safety of the system under test needs to be ensured during the measurements by supervising critical output signals.
This thesis covers different methods to tackle this task, namely for stationary and dynamic design of experiments. Therefore, two strategies are presented and analyzed: on the one hand the use of an offline generated design of experiment, on the other hand the use of active learning. The first strategy is threefold. It starts with the identification of the stationary safe system boundary. Thereafter a dynamic design of experiment is created within the stationary safe boundary. Finally, a dynamic measurement is pursued, while the system under test is safeguarded by a newly introduced supervising controller. The second strategy uses a dynamic safe active learning approach. Thereby, the dynamic model is not anymore learned offline, after the whole measurement was completed, but online, in parallel to the measurement process. Instead of a predefined design of experiment, the queried trajectories are optimized iteratively based on the learned model. The optimization also considers dynamic safety constraints of the system under test.
Special emphasis is put on the application of these strategies to real-world measurements in the combustion engine domain. The various design of experiments, measurement, and active learning algorithms are compared and their specific advantages and disadvantages are discussed.

Abstract: Das Themengebiet der vorliegenden Arbeit ist die datenbasierte Modellbildung (Identifikation). Das Hauptaugenmerk liegt auf Verfahren der Eingangsselektion und der Versuchsplanung, die dazu dienen, Effekte des Fluchs der Dimensionlität abzuschwächen, indem sie spezielle Eigenschaften lokaler Modellnetze ausnutzen.
Der Modelltyp der lokalen Modellnetze ermöglicht die Aufteilung des Eingangsraums in die sogenannten Regelprämissen und -konklusionen. In dieser Arbeit entwickelte Verfahren im Bereich der Eingangsselektion nutzen diese einzigartige Eigenschaft lokaler Modellnetze aus. Potentielle Eingangsgrößen können individuell den Regelprämissen oder -konklusionen zugeteilt werden. Es wird gezeigt, dass sich ein besserer Bias/Varianz-Kompromiss durch die Ausnutzung dieser individuellen Zuordnung finden lässt. Des Weiteren eröffnen sich zusätzliche Interpretationsmöglichkeiten, da einer der beiden Eingangsräume direkt mit den Modellnichtlinearitäten verknüpft ist.
Der Beitrag der vorliegenden Arbeit im Bereich der Versuchsplanung betrifft sowohl aktive als auch passive Lernverfahren. Im Rahmen der passiven Lernverfahren werden Empfehlungen auf die folgenden drei Fragestellungen gegeben. Sollten (alle) Ecken im Versuchsraum vermessen werden? Welcher raumfüllende Versuchsplan führt voraussichtlich zur höchsten Modellgüte? Welche Reihenfolge sollte beim Vermessen eines Versuchsplans eingehalten werden? Der Beitrag im Bereich aktiver Lernverfahren umfasst eine Erweiterung des bereits bestehenden Algorithmus „Hierarchical Local Model Tree for Design of Experiments“ (HilomotDoE). Drei Schlüsselaspekte der experimentellen Modellbildung werden dabei adressiert: (I) Optimalität, (II) geringer Bias- und (III) Varianzfehler.
Die entwickelten Methoden zeigen anhand ausgewählter Anwendungsbeispiele ihre Stärken. Dazu zählen: Die Vorhersage des Verbrauchs von Kraftfahrzeugen, die Modellierung des Luftmassenstroms für Verbrennungsmotoren, die Metamodellierung für Ventilatoren und die Erzeugung eines dynamischen Modells zur Regelung eines Heizungs-, Lüftungs- und Klimatisierungssystems.

Abstract: In der vorliegenden Arbeit werden neue Verfahren zur experimentellen, datenbasierten Modellbildung (Identifikation) und zur Versuchsplanung nichtlinearer Systeme mit Hilfe von lokalen Modellnetzen vorgestellt.

Die aus dieser Arbeit hervorgehenden Algorithmen basieren einerseits auf einer detaillierten Analyse und Weiterentwicklung der linearen Optimierung lokal gewichteter, polynomialer Modelle hinsichtlich Parameterschätzung, Regularisierung, Validierung und Strukturselektion. Andererseits bedarf es nichtlinearer Optimierungsverfahren, um die Gültigkeitsgebiete der lokalen Modelle an den nichtlinearen Prozess anzupassen. Dazu werden geeignete, heuristische Partitionierungsstrategien entwickelt, die durch sukzessive Unterteilung des Eingangsraums in der Lage sind, lokale Modellnetze effizient an die zugrunde liegenden Prozessdaten anzupassen. Dazu bedienen sich die untersuchten Verfahren achsenschräger Teilungsstrategien, welche sich durch eine flexible Partitionierung insbesondere für höherdimensionale Probleme eignen. Zudem wird eine Strategie vorgestellt, bei der automatisch eine Abwägung stattfindet, ob das Modell entweder mit einer achsenschrägen Teilung flexibilisiert oder ob die Anzahl der zu selektierenden Regressoren der Teilmodelle erhöht werden soll. Die Partitionierung und die lokale Selektion der signifikanten Polynomterme erfolgen hierbei simultan.

Darüber hinaus bietet die Umsetzung des neu entwickelten "Hierarchical Local Model Tree"-Algorithmus’ (HILOMOT) als statistisches Versuchsplanungsverfahren neue Möglichkeiten für praktische Anwendungen. Neben einer Offline-Versuchsplanung können nichtlineare Prozesse, für die kein a priori-Wissen zur Verfügung steht, mit dem Algorithmus aktiv gelernt werden. Das aktive Lernverfahren ist in der Lage, online mit dem Prozess zu interagieren und den Anforderungen entsprechend die Messpunkte effizient zu platzieren.

Die vorgestellten Algorithmen werden durch die Anwendung an realen Systemen verifiziert und deren Leistungsfähigkeit unter Beweis gestellt. Dazu zählt die Modellierung des Verbrauchs und der Emissionskenngrößen eines modernen Dieselmotors, die aktive Versuchsplanung im Rahmen eines Structural Health Monitoring-Systems und die adaptive Online-Versuchsplanung am Motorenprüfstand zur Kalibrierung eines Dieselmotors.

Abstract: Haptisch unterstützte Bedienkonzepte finden gegenwärtig in mobilen Arbeitsmaschinen, wie z. B. Hydraulikbaggern, keine Anwendung. Zurzeit werden diese Maschinen mit hydraulischen Joysticks bedient. Jede Joystickachse steuert einen einzelnen hydraulischen Aktor (z. B. Zylinder), was aufgrund der nicht immer übereinstimmenden Bewegungsarten und -richtungen zu einer wenig intuitiven Bedienung führt. Erst seit der Verfügbarkeit elektrohydraulischer Systeme für den Serieneinsatz sind auch alternative intuitive Bedienkonzepte mit elektronischen Vorsteuergeräten möglich. Diese Konzepte können durch haptisch unterstützte Assistenzsysteme erweitert werden. Haptisch unterstützte Bedienkonzepte zielen auf eine effizientere Mensch-Maschine-Interaktion, eine Reduzierung von Bedienfehlern und eine Verkürzung der Einlernzeit unerfahrener Bediener.
In der vorliegenden Arbeit wird ein Master-Slave-Bedienkonzept für einen Hydraulikbagger vorgeschlagen, welches den Fahrer über haptische Interaktion bei der Maschinenführung unterstützt. Das Bedienkonzept beinhaltet intuitive, aktive Bedienelemente, die eine Alternative zur herkömmlichen Maschinensteuerung mit Joysticks darstellen, und eine bilaterale Reglerarchitektur für das Gesamtsystem, bestehend aus Bagger und Bediengerät. Die Bedienelemente, welche die kinematische Kette des Arbeitsarms nachbilden, versprechen eine intuitive Bedienung der Maschine. Für die ständige Synchronisation der Bedienelemente mit der aktuellen Position des Hydraulikbaggers müssen diese mit Aktoren ausgestattet und positionsgeregelt sein. In der vorgeschlagenen Reglerarchitektur geben sich beide Systeme jeweils gegenseitig die Führungsgröße für die Positionsregelung vor. Der Bediener wirkt als Störung auf das System. Diese Architektur ermöglicht eine stabile Regelung und gibt dem Bediener ein haptisches Feedback der Trägheit des hydraulischen Manipulators. Die Regler für die elektrischen bzw. hydraulischen Aktoren von Bedienelementen und Bagger werden mit Hilfe der Entwurfsmethode Internal Model Control ausgelegt. Dazu wird ein bekannter Ansatz auf integrierende Strecken erweitert. Zur Verbesserung der Regelgüte wird eine Stellgrößenbeschränkung über ein Zustandsvariablenfilter für Systeme mit integrierenden Strecken vorgeschlagen.
Ein weiterer Aspekt der Arbeit ist die Nutzung der Aktoren der Bedienelemente zur Implementierung von haptischen Assistenzsystemen. Diese unterstützen den Fahrer bei verschiedenen Arbeitsaufgaben (z. B. Planieren, Böschungsbau, Kollisionsvermeidung) durch fühlbare Kräfte, die das Bedienelement an den Fahrer zurückgibt.
Um das Bedienkonzept zu verifizieren, wird ein echtzeitfähiger Virtual Reality Baggersimulator und ein mit elektronisch vorgesteuerten Hydraulikventilen, Rapid Control Prototyping Hardware und Sensorik ausgerüsteter Versuchsbagger verwendet. Zur prototypischen Umsetzung der Bedienelemente am Versuchsbagger werden kommerziell verfügbare Bediengeräte, ein SensAble Phantom Omni und ein 3Dconnexion SpaceBall 5000, eingesetzt. Es werden Ergebnisse aus experimentellen Messungen angegeben.
Zur Bewertung des vorgeschlagenen Bedienkonzepts sowie der haptischen Assistenzfunktionen werden Experimente mit Probanden am Versuchsbagger durchgeführt, welche die Intuitivität des Konzepts und die Funktionalität der Assistenzsysteme bestätigen.
